Abstract (English)
The built environment is expanding faster than it is decarbonizing, shifting climate impact to upfront embodied emissions. Geopolymers and bamboo are low-carbon alternatives with high product variability, complicating design, specification and widespread deployment. While existing conventional empirical models are transparent, they struggle to predict high-dimensional mix and geometric complexity of these materials. This study develops a layered explainable-AI (XAI) framework for multi-output AI models to translate accurate predictions into transparent data-driven guidance for low-carbon design. Four machine learning (ML) models: RF, XGB, SVR, and MLP, are trained to jointly predict compressive strength (CS), slump flow (SL), and embodied carbon (EC) for 885 fly ash–slag geopolymer mixes, and bending strength (BS), modulus of elasticity (MOE), and EC for 102 bamboo culms. The best models achieve test = 0.86-0.98, matching recent single-output models while enabling multi-output prediction. The layered XAI framework then explains input influence on predictions. SHapley Additive exPlanations (SHAP) identify mix and culm variables most strongly contributing to each performance indicator across the full dataset. SHAP-space clustering groups these into behavioral regimes where a thermodynamics-inspired local surrogate method (TERP) fits sparse, locally faithful rules that identify key variables governing local prediction behavior. Partial dependence plots (PDPs) then quantify these rules, highlighting both favorable corridors and high-risk regions in the design space. In geopolymers, high CS, adequate SL, and moderate EC coincide around GGBFS = 300-420 kg/m3, FA = 200-280 kg/m3, Ac/B = 0.38–0.44, Na₂SiO₃ = 100–130 kg/m³, SiO₂/Al₂O₃ = 1.6–1.9, and final curing temperatures ≤ 35 °C. For bamboo, a mid-range geometry: diameter = 85–95 mm, linear mass = 1.6–2.0 kg/m, densities ≥ 725 kg/m³ and wall thickness ≤ 8 mm, balances BS, MOE and EC. The study shows that multi-output, explainable AI can provide accurate predictions with traceable mix and culm design, enabling transparent and informed decisions for sustainable construction.

Sa patuloy na paglawak ng built environment, ang mga hakbang sa pag-dedecarbonize ng mga ito ay nahuhuli, kaya lumilipat ang pasanin sa klima patungo sa mga emisyong galing sa paggawa at konstruksyon (embodied emissions). Ang geopolymer at kawayan (bamboo culms) ay mga alternatibong mas mababa ang emisyon ngunit limitado ang malawakang paggamit dahil sa malaking pagkakaiba-iba ng katangian ng mga produktong ito na nagpapahirap sa pagdisenyo at espesipikasyon. Sa pag-aaral na ito, binuo ang isang layered explainable AI (XAI) framework para sa mga multi-output AI prediction model upang ang eksaktong mga prediksyon ay magamit bilang gabay batay sa datos para sa disenyo ng mga materyales na mababa ang emisyon. Sinanay ang apat na machine learning (ML) models: RF, XGB, SVR, at MLP sa sabay-sabay na pagtataya ng compressive strength (CS), slump flow (SL) at embodied carbon (EC) mula sa 885 datos ng iba-ibang halo ng fly ash–slag geopolymer, gayundin ang bending strength (BS), modulus of elasticity (MOE), at EC sa 102 datos ng mga kawayan. Ang SHapley Additive exPlanations (SHAP) ay nagtukoy ng pinakamahalagang input na may pinakamalakas na impluwensya sa bawat performance indicator sa buong dataset. Gamit ang clustering, ipinangkat ang mga SHAP value upang tukuyin ang mga behavioral regimes kung saan nilapat ang TERP, isang lokal na surrogate method na naglalarawan ng mga simple ngunit matapat na patakarang ginagamit ng modelo upang makapagtaya sa loob ng bawat regime. Ang Partial Dependence Plots (PDPs) ay ginamit upang mailarawan sa numero ang mga patakarang ito. Para sa geopolymer, tampok na nagtutugma ang mataas na CS, sapat na SL, at katamtamang EC sa mga halong may GGBFS = 380–420 kg/m³, FA na 200–280 kg/m³, Ac/B na 0.38–0.44, Na₂SiO₃ na 100–130 kg/m³, SiO₂/Al₂O₃ na 1.6–1.9, at pinal na curing temperature na hindi lalampas sa 35 °C. Para naman sa kawayan, nakita ang balanseng BS, MOE, at EC sa mga kawayang may diameter na 85–95 mm, linear mass na 1.6–2.0 kg/m, density na ≥ 725 kg/m³, at wall thickness ≤ 8 mm. Sa kabuuan, ipinapakita ng pag-aaral na ang multi-output at explainable AI ay makapagbibigay ng mataas na katumpakan at masusubaybayang batayan sa disenyo ng materyal, na tumutulong sa mas malinaw at matalinong desisyon tungo sa konstruksyon na susteynabol (sustainable).
